How Organisations Adopt AI: The Adoption Journey and ROI Frameworks
Most AI projects fail before they reach production. Not because the technology is hard. Not because the models don't work. They fail because the organisation isn't ready for them.
Understanding the typical adoption journey - where organisations actually are, what happens next, where they get stuck - matters more than understanding the models themselves.
The typical stages of AI adoption
Experimentation. Organisations start here. Someone reads about AI, gets excited, builds a proof of concept. The model works in a notebook. It's impressive in a demo. Everyone agrees: AI could help us. This is cheap - a few people spend a month and produce something that works. But it's not production. It's a prototype that might never ship.
Pilot projects. Some experiments graduate to pilots. You deploy the model in a limited context - maybe one team, maybe 10% of customers. You measure whether it works in the real world. This costs money. You need infrastructure to serve the model, integration with existing systems, handling of edge cases and failures. Many projects die here because integration is harder than the model itself.
Scale-out. Successful pilots get deployed more widely. One team that used the model becomes everyone. Suddenly you need more infrastructure, more monitoring, more maintenance. This is where organisations learn that ML in production is nothing like ML in notebooks.
Systematic integration. Mature organisations have ML integrated into their core operations. They have data pipelines, model retraining, monitoring, MLOps infrastructure. Building an ML system isn't special any more - it's a normal engineering project.
Most organisations never reach here. They get stuck in pilots.
Why most AI projects fail before production
The typical story: a team builds an impressive model. 89% accuracy. Everyone's excited. They try to deploy it. Then reality hits. The data in production is different. Integration with existing systems is harder than expected. The model is slow. It breaks on edge cases nobody anticipated. The business stakeholder who was excited doesn't have budget for the infrastructure to serve it. The project stalls. It gets reprioritised. It eventually gets cancelled.
Unclear business case. Nobody clearly defined what problem the model is solving. "AI will improve our process" is not a business case. "AI will reduce customer churn by 5% saving us £2 million a year" is. Without the second, the project is vulnerable.
Mismatch with actual operations. The model solves a problem that sounds important but isn't, or requires data that isn't available, or requires human process changes the organisation resists.
Underestimated integration effort. Getting a model into a production system is mostly integration work, not model work. This surprises people. They build the model in three months and then spend a year trying to get it to work in their system.
Lack of data. You promised high accuracy but you don't have enough training data. Or the data is low quality. Or you can't label it fast enough.
Technical debt. Your infrastructure doesn't support ML. Your data pipeline is chaotic. Before you can deploy AI, you need to fix other things first.
Most failures are organisational, not technical. The model is fine. The organisation isn't ready.
What good ROI framing looks like
A good business case for AI has a specific problem - not "improve customer experience" but "reduce time customer service reps spend on password resets by 50%." It has a measurable baseline: what's the current situation, what does it cost us in labour? It has clear success metrics that you can actually measure. It has expected financial impact with real numbers. Implementation cost. And payback period.
If it costs £100,000 to build and implement and saves £5,000 per month, payback is 20 months. Is that acceptable? Does that timeline work?
Nobody gets excited about payback periods. But this is how projects get funded and survive organisational changes.
Vanity metrics are the opposite: "Our AI model achieved 92% accuracy." "We deployed an AI system." Nobody with budget cares. They care about problems solved and money saved.
The difference between AI adoption and AI transformation
Adoption is using AI somewhere in your organisation. A team uses a model. It works. They got that benefit. But the rest of the organisation is unchanged.
Transformation is rethinking how your organisation operates given AI capabilities. You're not adding AI to existing processes - you're redesigning processes knowing AI is available.
Adoption is easier. You don't have to change much. Find a clear problem, build a model, deploy it.
Transformation is harder but the potential payoff is bigger. It requires buy-in across the organisation. It requires changing how people work. Most organisations do adoption when they should be thinking about transformation. They add AI as a feature instead of rethinking what's possible.
Where most organisations actually are
Most organisations are still in the experimentation stage. They've built some models. Maybe they've deployed something in production. But it's not systematic. It's not core to how they operate. If the person who championed the AI project leaves, the project gets deprioritised.
Of 100 large organisations, maybe 10 have genuinely transformed how they operate using AI. Maybe 30 have successful pilot projects running. The rest are still experimenting.
The constraint is organisational readiness, not technical capability. The technology is the easy part. Building the infrastructure, getting buy-in, defining clear problems, finding people who understand both AI and the business - that's hard.
Organisations that succeed at AI treat it seriously. They invest in it. They change incentives to reward AI-driven decisions. They build the infrastructure. They accept that early projects might fail and do them anyway. Most organisations want the benefits of AI without the effort. That's why most projects fail.
